@C5H8NNaO4 Linear Algebra Done Right by Axler is a good start. Take it easy and read it bits at a time. Also, Calculus by Michael Spivak. Read them bits at a time and do all the exercises even if they take a few hours or alternatively if they're boring.
They're both solid reads and are very introductory, use Kahn Academy and other online video lectures when appropriate. When you're done with these two books let me know and we'll get into more interesting stuff like how you can apply this 'totally theoretical stuff' and build real stuff in it.
